Learning Halfspaces with Malicious Noise

چکیده
We give new algorithms for learning halfspaces in the challenging malicious noise model, where an adversary may corrupt both the labels and the underlying distribution of examples. Our algorithms can tolerate malicious noise rates exponentially larger than previous work in terms of the dependence on the dimension n, and succeed for the fairly broad class of all isotropic log-concave distributions. We give poly(n,1/ε)-time algorithms for solving the following problems to accuracy ε: • Learning origin-centered halfspaces in Rn with respect to the uniform distribution on the unit ball with malicious noise rate η = Ω(ε2/ log(n/ε)). (The best previous result was Ω(ε/(n log(n/ε))1/4).) • Learning origin-centered halfspaces with respect to any isotropic logconcave distribution on Rn with malicious noise rate η = Ω(ε3/ log2(n/ε)). This is the first efficient algorithm for learning under isotropic log-concave distributions in the presence of malicious noise. We also give a poly(n,1/ε)-time algorithm for learning origin-centered halfspaces under any isotropic log-concave distribution on Rn in the presence of adversarial label noise at rate η = Ω(ε3/ log(1/ε)). In the adversarial label noise setting (or agnostic model), labels can be noisy, but not example points themselves. Previous results could handle η = Ω(ε) but had running time exponential in an unspecified function of 1/ε. Our analysis crucially exploits both concentration and anti-concentration properties of isotropic log-concave distributions. Our algorithms combine an iterative outlier removal procedure using Principal Component Analysis together with “smooth” boosting.

Learning large-margin halfspaces with more malicious noise
We describe a simple algorithm that runs in time poly(n, 1/γ, 1/ε) and learns an unknown n-dimensional γ-margin halfspace to accuracy 1 − ε in the presence of malicious noise, when the noise rate is allowed to be as high as Θ(εγ √ log(1/γ)). Previous efficient algorithms could only learn to accuracy ε in the presence of malicious noise of rate at most Θ(εγ). Our algorithm does not work by optim...
متن کاملLearning Geometric Concepts with Nasty Noise
We study the efficient learnability of geometric concept classes – specifically, low-degree polynomial threshold functions (PTFs) and intersections of halfspaces – when a fraction of the training data is adversarially corrupted. We give the first polynomial-time PAC learning algorithms for these concept classes with dimension-independent error guarantees in the presence of nasty noise under the...

We give the first polynomial time algorithm to learn any function of a constant number of halfspaces under the uniform distribution on the Boolean hypercube to within any constant error parameter. We also give the first quasipolynomial time algorithm for learning any Boolean function of a polylog number of polynomial-weight halfspaces under any distribution on the Boolean hypercube. As special ...
متن کاملLearning Halfspaces with the Zero-One Loss: Time-Accuracy Tradeoffs
Given α, , we study the time complexity required to improperly learn a halfspace with misclassification error rate of at most (1 + α)Lγ + , where L ∗ γ is the optimal γ-margin error rate. For α = 1/γ, polynomial time and sample complexity is achievable using the hinge-loss. For α = 0, Shalev-Shwartz et al. [2011] showed that poly(1/γ) time is impossible, while learning is possible in time exp(Õ...
