Abstract The universal approximation property of various machine learning models is currently only understood on a case-by-case basis, limiting the rapid development new theoretically justified neural network architectures and blurring our understanding current models’ potential. This paper works towards overcoming these challenges by presenting characterization, representation, construction method, an existence result, each which applies to any approximator most function spaces practical interest. Our characterization result used describe activation functions allow feed-forward architecture maintain its capabilities when multiple constraints are imposed final layers remaining sparsely connected. Universal Approximator Property of the Space of Hyperbolic Tangent Functions

In this paper, first the space of hyperbolic tangent functions is introduced and then the universal approximator property of this space is proved. In fact, by using this space, any nonlinear continuous function can be uniformly approximated with any degree of accuracy. The Strong Approximation Property and the Weak Bounded Approximation Property

We show that the strong approximation property (strong AP) (respectively, strong CAP) and the weak bounded approximation property (respectively, weak BCAP) are equivalent for every Banach space.
